Your AI Agent Is Only as Good as Its Context

Most agentic AI systems fail not because the model is wrong but because the context is bad. How you organize, retrieve, and pass context is the discipline that separates working systems from expensive demos.

Here is the most common pattern in AI projects that stall after the demo:

The demo works because someone spent an hour crafting the perfect prompt with the right examples, the right framing, and the right data included. The production system fails because the same quality of context doesn’t exist at runtime — the agent gets whatever’s available, not whatever’s needed.

This is a context problem. And it’s the problem that most AI teams are underinvesting in.

Why Models Get Blamed for Context Failures

When an AI agent produces a wrong answer, the first instinct is to question the model. “Maybe we need a smarter LLM.” “Maybe GPT-4o would do better than Claude.” “Maybe we need fine-tuning.”

Sometimes that’s right. More often, the model is capable of the task — it just didn’t have what it needed to complete it well. The context was incomplete, stale, ambiguous, or structured in a way the model couldn’t use effectively.

Switching models with the same bad context produces a slightly different wrong answer.

Fixing the context with the same model produces a right answer.

The Four Types of Context an Agent Needs

When designing an agentic system, there are four distinct types of context to think about:

1. Working context — What the agent is doing right now. The current task, the most recent tool results, the immediate conversation history. This lives in the active context window and gets passed through the prompt. For most agents, this is the only context being managed — and it’s necessary but not sufficient.

2. Episodic context — What the agent has done before. Past runs, past decisions, past outputs. Without episodic context, an agent treating the same situation on Tuesday the same as it did on Monday. With it, the agent knows “we tried this approach last week and the customer rejected it” or “this report was flagged as incorrect in the last review cycle.”

3. Semantic context — What the agent knows about the world. Company information, product details, definitions, policies, historical data. This is the domain knowledge that makes the agent’s responses accurate rather than generic. It’s also where RAG (retrieval-augmented generation) becomes valuable — instead of loading all of this into every prompt, you retrieve only the relevant pieces at runtime.

4. Procedural context — How the agent should work. Instructions, constraints, output formats, escalation rules. Most teams encode this in system prompts. The mistake is treating it as static — as the system evolves, the procedural context needs to evolve with it, and there needs to be a process for updating it.

The RAG Mistake Most Teams Make

Retrieval-augmented generation solves a real problem: you can’t fit everything the agent might need into a context window, so you retrieve only what’s relevant at runtime.

The mistake is treating RAG as a magic solution rather than a design discipline.

Two things go wrong most often:

Retrieving the wrong things. The retrieval step uses semantic similarity — it finds content that sounds like the query. But “sounds like” is not the same as “is relevant to.” An agent answering a question about Q2 budget allocation will retrieve documents that mention “budget” — including the one from three years ago that’s completely outdated. Without filtering on recency, source, or domain, the retrieved context is noise as often as it is signal.

Retrieving too much. The context window is not free. Every token you put into it is a token that can’t be used for reasoning. Retrieving 20 documents when 3 are relevant dilutes the signal. The model has to figure out what’s important from what you gave it — and that inference costs you accuracy.

Good RAG design is as much about what you don’t retrieve as what you do. Metadata filtering, recency weighting, source ranking, and confidence thresholds are as important as the embedding model.

Structuring Context for Marketing and Data Use Cases

Marketing and data contexts have specific characteristics that affect how context should be structured:

Time sensitivity is high. A performance report from last week might be irrelevant to a question about today’s campaign. Build time decay into your retrieval system — retrieved context should be tagged with date, and your retrieval logic should weight recency.

Data freshness matters more than completeness. An agent answering “which campaigns are underperforming” needs recent performance data. An agent summarizing a brand’s positioning needs older, more stable knowledge. These have different retrieval strategies and shouldn’t be handled the same way.

Numbers need provenance. When an agent says “Meta ROAS is 3.2x,” the downstream user needs to know: from which date range? Which attribution model? Which campaign grouping? Context that includes raw numbers without metadata produces confident-sounding wrong answers. Provenance metadata should be part of every data chunk you index.

Business definitions vary by organization. “Conversion,” “new customer,” “attributed revenue” mean different things at different companies. The semantic context layer needs to include your organization’s specific definitions, not generic ones from the web. This is often the most valuable thing to invest in early — a well-maintained glossary of terms with your organization’s definitions, indexed and retrievable.

The Context Update Problem

Context rots. The product positioning from last year is wrong. The campaign structure changed. The team’s decision-making criteria shifted after the board meeting.

Static RAG indices go stale. The agent keeps retrieving outdated information and producing confidently incorrect answers. This is one of the hardest operational problems in production agentic systems.

Three approaches that help:

Source-of-truth indexing. Index from authoritative sources that are already maintained: your CRM, your documentation system, your data warehouse. When those update, the index updates. The discipline of “only index from maintained sources” prevents you from creating a parallel documentation burden.

Expiry metadata. Tag indexed content with an expiry date or a review date. Surface content that hasn’t been reviewed in 90 days as “potentially stale” rather than removing it — it might still be correct, but the agent (and the human reviewing outputs) should know.

Feedback loops. When an agent output gets corrected, that correction is signal. Was it a context problem (missing information) or a reasoning problem (wrong model behavior)? Build the infrastructure to capture this distinction. Over time, the pattern of corrections tells you exactly which parts of your context layer need work.

Context Is Infrastructure

The right mental model for context management is infrastructure, not content.

It should be designed, maintained, versioned, and monitored like your data pipelines. It degrades over time and needs active upkeep. The quality of your AI outputs is a direct function of the quality of your context layer.

Most teams treat it as an afterthought — something to assemble quickly before the demo and revisit when something breaks. The teams building reliable AI systems treat it as a first-class investment from day one.

The model is a commodity. Context is the competitive advantage.
